I think it's more they were 'allies' during WW2 but never physically interacted so all Japan got was the asthetic which, let's be honest, the Germans knew how to present.
It's one of the reasons why unlike the west they aren't presented as 'they were evil incarnate' for a certain time period. Despite....similar war crimes, Japan didn't get split and most of their criminals got off free so they don't have the baggage.
The Wehraboo is strong in Japan.

It's pretty much an ongoing chuunibyou joke. Honestly don't know why the German/Latin thing came about, but those chuunis certainly love using them to name those "cursed dark powers within my arm/eye that I cannot control!!"
